About 18 billionaccounts are published each year only in the United States and Europe. Form-type documents, such asaccounts, purchase orders, tax forms, and insurance quotes are common in everyday business, but current techniques to process them still require a lot of manual effort and time or use OCR-based heuristics for extraction. While OCR has been quite successful in digitizing machine-printed text, the cost of these services can multiply exponentially.

Building a program to automate such an application would greatly reduce the money and manpower needed to physically process these invoices, making them more accessible and beneficial to the overall business and demand for these products. Additionally, these automated systems will greatly reduce the manual or human errors that occur.

Handling invoices and streamlining checks to avoid bottlenecks caused by manual processing was one of the main reasons for developing this process.

This easy implementation will help various industries that focus on invoice processing, especially automotive, product based, network and router based, etc. and therefore in any company that needs invoice processing. Invoice processing can be useful for tracking transaction activity and can be a useful fraud detection tool. This app will reduce the waste of resources and it will be a very useful tool.

To create such an application, our first step would be to find a suitable dataset for our application. we use itSROIE registration,que consiste em um conjunto de dados de 1.000 imagens de recibos totalmente digitalizadas e anotações para a competição Receipt Scanned OCR and Key Information Extraction (SROIE).

The record contains multiple images of these invoices along with a JSON file with details about thembounding box and textgifts in this box.

import libraries

We will use the basic machine learning libraries such asCV2, PandasEtaubalong withjsonLibrary for reading and editing JSON files.SequenceMatcher The library is used for NLP match sequencing that useslongest contiguous matching subsequence (LCS).Other libraries are the usual support libraries used in building Python projects.

from PIL import image
from tqdm import tqdm
from IPython.display import display

from matplotlib import pyplot, patches

Pre-process data set

Only a few pre-processes are needed before we can feed them into our model for training:

Reading the words and bounding boxes— For each path file we iterate through each line that has the format [boundary coordinates, text], divide each line into parts by ' , ' and extract the 2 corners of each box (since we only need 2 points to draw a rectangle) and the associated text. We convert and return all information from each image to a pandas dataframe.

def readboxandwords(path: path):
bbox_and_words_list = []

mit open(path, 'r', errors='ignore') als f:
for line in f.read().splitlines():
if len(line) == 0:
continue

split_lines = line.split(",")

bbox = np.array(split_lines[0:8], dtype=np.int32)
text = ",".join(split_lines[8:])

bbox_and_words_list.append([caminho.tronco, bbox, texto])

dataframe = pd.DataFrame(bbox_and_words_list, column=['filename', 'x0', 'y0', 'x1', 'y1', 'x2', 'y2', 'x3', 'y3', 'linha' ], dtype=np.int16)
dataframe = dataframe.drop(columns=['x1', 'y1', 'x3', 'y3'])

Return data frame

Assign labels to words— The image dataset provided did not contain any classification on the data type of the individual bounding box information contained within it, ie H. if the information provided pertains to date, address, company name, etc. in this context (we only receive the company name, full address, date and price separately). Then we try to map each entity to one of the 4 options given in the JSON file comparing it to the original data.

def assign_line_label(line: str, entities: pd.DataFrame):
line_set = line.replace(",", "").strip().split()
for i, column in enumerate(entities):
entity_values = entities.iloc[0, i].replace(",", "").strip()

for l in line_set:

(column.upper() != 'ADDRESS' und (matches_count == len(line_set))) oder \
match_count == len(entity_set):
column.upper()

return "O".

def Assign_Labels(words, entities):

Create dataset module— Finally, we wrap the dataset in a module that contains all the necessary information in a predefined standardized form to easily train the model. We've also added the tqdm library to display a progress bar to make it easier to see the progress of the model.

Import the LayoutLM template

OLayoutLMmodel is a simple but effective text and layout pre-training method for understanding document images and information extraction tasks, therefore perfect for processing semi-structured invoice images. This model is available atMicrosoftembraced face library, so we can install or use it directly from huggingface. We will use the previous method.

Git-Clone https://github.com/microsoft/unilm.git
cd unilm/layoutlm/obsolete
Install the tube.

Next, we load the basic LayoutLM model, as our usage is minimal and wouldn't require much of a high model size.

pretrained_model_folder_input= sroie_folder_path / Path('layoutlm-base-uncased')

pretrained_model_folder=Pfad('/layoutlm-base-uncased/')
label_file=path(dataset_directory, "labels.txt")

train the model

We need to run the files - run_seq_labeling.py to train the model while providing all the necessary information.

# REGISTRATION TRAINING
python run_seq_labeling.py \
--data_dir /dataset \
--labels /dataset/labels.txt \
--model_name_or_path "{pasta_do_modelo_pretreinado}" \
--model_type layoutlm \
--max_seq_length 512 \
--do_lower_case \
--do_train \ #By specifying do_train, we tell the program to train
--num_train_epochs 10 \
--logging_steps 10 \
--save_steps -1 \
--output_dir output \
--overwrite_output_dir \
--per_gpu_train_batch_size 8 \
--per_gpu_eval_batch_size 16
# TEST IN THE REGISTRY
# Evaluate against the test set and make predictions
! python run_seq_labeling.py \
--data_dir /dataset \
--labels record/labels.txt \
--model_name_or_path "{pasta_do_modelo_pretreinado}" \
--model_type layoutlm \
--do_lower_case \
--max_seq_length 512 \
--do_predict \ #replacing do_train with do_predict, we can instruct the model to make predictions on the given dataset
--logging_steps 10 \
--save_steps -1 \
--output_dir output \
--per_gpu_eval_batch_size 8

testing the model

We can read them nowexpected datesand images of the bounding box and write it down on the invoice image and compare it to the oneoriginal dataon the invoice image (bounding boxes have been noted) to see how the image was trained.

From the above results, we can clearly see that the model is predicting very close to the land value. There are certain instances of discrepancy like the last set of images where the model fails to identify the total cost.

With more hyperparameter optimization and fine-tuning of LayoutLM, the accuracy can be improved and the model can be trained to recognize many more classes than 4 very quickly with just the basic boxless model.

Note that it may take some time to run as the model needs to be loaded and trained.

Invoice processing is challenging when done manually, but with our design we are able to significantly reduce the manual checking and processing required while improving and supporting industry standards.
